Best architecture: an end-to-end ML platform (MLOps)

From raw data to monitored predictions, with every step automated and reproducible.

ML lifecycle

  1. Data sources
  2. Pipelines + validation
  3. Feature store
  4. Training + experiment tracking
  5. Model registry
  6. Serving (batch / API)
  7. Monitoring → retrain

Why it's built this way

  • Feature store gives identical features in training and serving.
  • Experiment tracking + registry make every model reproducible and auditable.
  • Choose batch predictions unless you truly need real-time.
  • Monitor drift and accuracy, and trigger retraining automatically.

PrecisionTP / (TP + FP)
RecallTP / (TP + FN)
F1Harmonic mean of precision and recall
ROC-AUC / PR-AUCRanking quality; PR-AUC for rare positives
RMSE / MAERegression error (RMSE punishes big errors)

Fix-it table

OverfittingMore data, regularisation, simpler model, early stopping
UnderfittingMore features, bigger model, train longer
LeakageTime-based splits, audit features
DriftMonitor, retrain, alert

Improve performance

  • Use batch inference where real-time isn't needed.
  • Quantise or distil models for faster serving.
  • Use GPUs for deep learning; CPUs are often fine for tree models.
  • Cache features and predictions for repeated inputs.
  • Profile data loading; it's often the bottleneck in training.

Security checklist

  • Protect training data and PII; apply access controls and anonymisation.
  • Validate inputs to model APIs; guard against adversarial inputs.
  • Version and sign model artefacts; control who can deploy.
  • Monitor for data poisoning in pipelines that ingest external data.
  • Log predictions for auditing, respecting privacy rules.

Most important interview questions

Click a question to see a strong answer. Each step also has its own questions.

1Explain the bias–variance trade-off.

Simple models have high bias (underfit); complex models have high variance (overfit). The goal is the complexity that minimises error on unseen data.

2cross-validation என்றால் என்ன?

Splitting data into k folds, training on k−1 and validating on the remaining fold k times, to get a more reliable performance estimate.

3Random forest vs gradient boosting?

Random forests average many independent trees (robust, less tuning). Gradient boosting builds trees sequentially to fix errors (often more accurate, needs tuning).

4How do you deploy an ML model?

Package model and preprocessing, serve via batch jobs or an API container, add monitoring for latency, errors and drift, and automate retraining and rollback.

5regularisation என்றால் என்ன?

Techniques that penalise complexity (L1/L2, dropout, early stopping) to reduce overfitting.

Maths for ML, the practical way

Linear algebra, calculus and statistics you actually use.

You need intuition more than proofs: what a gradient is, why gradient descent works, how probability expresses uncertainty. Learn each idea with NumPy code next to it.

The goal is to read model documentation and papers without getting lost.

What you'll learn

  • Vectors, matrices and dot products
  • Derivatives and gradients
  • Probability and distributions
  • Mean, variance and correlation
  • Gradient descent
  • Overfitting intuition

Gradient descent

  1. Predict
  2. Compute loss
  3. Compute gradients
  4. Update weights

Repeats as a loop

Key concepts

Gradient
The direction of steepest increase of the error; step the opposite way.
Learning rate
How big each step is. Too big diverges, too small is slow.
Loss function
A number measuring how wrong the model is.

Step by step

  1. 1.1

    Vectors and matrices

Dot products, matrix multiplication, shapes in NumPy.

  2. 1.2

    Derivatives

Slope = how output changes with input; gradients for many inputs.

  3. 1.3

    Probability

Distributions, mean, variance, Bayes' rule intuition.

  4. 1.4

    Gradient descent

Implement it for linear regression in NumPy.

Notes

  • Gradient descent is just 'take small steps downhill on the error'.

Tips & tricks

  • Implement linear regression from scratch with NumPy once.
  • Use visual courses for linear algebra.

Interview questions

Explain gradient descent.

An optimisation method that repeatedly moves the weights opposite to the gradient of the loss, by a step size set by the learning rate, until the loss stops improving.

The quick way to study this

Pair a visual linear algebra series with coding each concept in NumPy.

Classical machine learning

scikit-learn, features and evaluation.

Most business ML is still tabular: predicting churn, fraud, demand or prices. Gradient-boosted trees are often the best model for this kind of data.

Evaluation is the core skill. A model is only as good as the metric you choose and how honestly you split data.

What you'll learn

  • Train/validation/test splits
  • Linear and logistic regression
  • Decision trees, random forests, gradient boosting
  • Feature engineering
  • Metrics: accuracy, precision, recall, AUC, RMSE
  • Cross-validation

Underfitting vs good fit vs overfitting

Underfit

  • Too simple
  • Bad on train and test

Good fit

  • Right complexity
  • Good on both

Overfit

  • Memorises
  • Great on train, bad on test

Key concepts

Precision vs recall
Precision: of predicted positives, how many were right. Recall: of real positives, how many we caught.
Data leakage
Training on information not available at prediction time.
Bias–variance trade-off
Too simple underfits; too complex overfits.

Step by step

  1. 2.1

    Split data

Train / validation / test, by time when data is time-based.

  2. 2.2

    Baseline

Start with a simple model or rule to beat.

  3. 2.3

    Models

Logistic regression → random forest → gradient boosting.

  4. 2.4

    Evaluate

Pick metrics that match business costs; use cross-validation.

Notes

  • Data leakage (future info in training data) is the most common silent bug.
  • Always compare with a simple baseline.

Tips & tricks

  • Do three Kaggle-style tabular problems end to end.
  • Plot your errors; patterns reveal missing features.

Interview questions

When would you prefer recall over precision?

When missing a positive is costly, e.g. fraud or disease screening. Prefer precision when false alarms are costly, e.g. spam filters deleting real mail.

How do you handle imbalanced classes?

Use suitable metrics (PR-AUC, F1), class weights or resampling, adjust the decision threshold, and collect more minority examples.

The quick way to study this

Learn the scikit-learn workflow (fit, predict, score) and repeat it on several datasets.

Practice project

Deep learning with PyTorch

Neural networks for images, text and more.

PyTorch is the standard framework for research and most production deep learning. Learn to write a training loop yourself, then use higher-level tools.

Transfer learning (starting from a pre-trained model) is how most real projects are done; training from scratch is rare.

What you'll learn

  • Tensors and autograd
  • Training loops
  • CNNs for images
  • Transformers for text
  • Transfer learning
  • GPUs and mixed precision

PyTorch training loop

  1. Load batch
  2. Forward pass
  3. Loss
  4. loss.backward()
  5. optimizer.step()

Repeats as a loop

Key concepts

Epoch
One full pass over the training data.
Batch
A small group of examples processed together.
Transfer learning
Reusing a pre-trained model as the starting point.

Step by step

  1. 3.1

    Tensors and autograd

PyTorch tensors on GPU; gradients computed automatically.

  2. 3.2

    Training loop

Forward → loss → backward() → optimiser step → zero grads.

  3. 3.3

    Transfer learning

Fine-tune a pre-trained model on your small dataset.

  4. 3.4

    Regularise

Dropout, weight decay, data augmentation, early stopping.

Notes

  • If loss is not decreasing, check learning rate and data first.

Tips & tricks

  • Overfit a tiny batch first to prove your loop works.
  • Use free cloud notebooks with GPUs for practice.

Interview questions

Your training loss isn't decreasing. What do you check?

Learning rate, data and labels (are they correct and aligned?), loss function choice, whether gradients flow (zero_grad, frozen layers), and overfit one small batch to verify the loop.

The quick way to study this

Fine-tune a pre-trained image model and a text model on small datasets.

Practice project

An image classifier fine-tuned on your own photo dataset.

Data pipelines and feature கடைகள்

Reliable data in, reliable models out.

Models fail in production mostly because data changes. Build pipelines that validate inputs, version datasets and produce the same features in training and serving.

Training-serving skew, where features are computed differently in each place, is a classic production bug.

What you'll learn

  • SQL and data warehouses
  • Batch pipelines
  • Data validation
  • Feature கடைகள்
  • Versioning data and models

ML data pipeline

  1. Sources
  2. Ingest
  3. Validate
  4. Transform features
  5. Feature store
  6. Train / serve

Key concepts

Training–serving skew
Features computed differently in training and production.
Feature store
A shared place for consistent, reusable features.

Step by step

  1. 4.1

    Ingest

Pull data from databases and APIs on a schedule.

  2. 4.2

    Validate

Check schemas, ranges and missing values before training.

  3. 4.3

    Feature store

Compute features once, reuse in training and serving.

  4. 4.4

    Version

Track dataset versions alongside code and models.

Notes

  • Version your data as carefully as your code.

Tips & tricks

  • Write data tests (no nulls, valid ranges) like unit tests.

Interview questions

training–serving skew and how do you prevent it என்றால் என்ன?

A mismatch between features at training and serving time. Prevent it by sharing feature code (or a feature store), validating inputs and monitoring feature distributions.

The quick way to study this

Build a small pipeline that fetches data daily, validates it and retrains a model.
